Third Party Calendar Apps Not Updating in Background

I wanted to use the Google calendar app. I use Google's calendar backend anyway, and I like their app's UI more than Apple's one. If I make a calendar event on the device, the app notifies just fine, but if I make the event on a different device, it doesn't ever seem to sync in the background and I'm never notified. When I open the app, the event appears after a few seconds.

I also tried Outlook and it's much the same. If I make the event on that device, it notifies. But if I make the event elsewhere, it doesn't know about it until I open the app.

Is this normal?
